Abstract: Large Language Models (LLMs) often falter when integrated into business applications, struggling with adherence to predefined output formats and susceptibility to user-manipulated rule deviations. This paper presents a groundbreaking solution, employing synthetic data generation techniques to develop Instruction-Following Models (IFMs) that strictly adhere to hardcoded output formats. We demonstrate the efficacy of this approach in two pivotal applications: analyzing prompts for toolchain integration with JSON-only outputs, and sentiment analysis via LLMs, leveraging Reinforcement Learning from Human Feedback (RLHF) in conjunction with a SteerLM-inspired classification framework.

Introduction:The burgeoning adoption of Large Language Models (LLMs) in enterprise environments is hindered by two primary challenges:

  1. Format Inconsistency: The propensity of LLMs to deviate from specified output formats when confronted with cleverly crafted user inputs, undermining downstream processing reliant on structured data.
  2. Contextual Misalignment: The inherent difficulty in constraining LLMs to analyze inputs without contaminating their responses with the analyzed text’s content, particularly pronounced in sentiment analysis tasks.

Methodology:

Synthetic Data Generation for Instruction-Following Models (IFMs)

  • Dataset Creation: Employ advanced synthetic data generation techniques to craft comprehensive datasets tailored to elicit strict adherence to predefined output formats from base LLMs.
  • Model Fine-Tuning: Utilize these datasets to fine-tune base models, resulting in IFMs that are “hard-wired” to generate outputs in a single, specified format (e.g., JSON for prompt analysis).

Application 1: Prompt Analysis for Toolchain Integration

  • Objective: Develop an IFM capable of analyzing diverse prompts (e.g., requests for XML or table data) without deviating from a JSON output format.
  • Outcome: Successful integration with toolchains, ensuring seamless downstream processing.

Application 2: Sentiment Analysis via LLMs

  • Challenge: Accurately analyze text sentiment without incorporating the text’s content into the response.

By “hard-wiring” output formats into Instruction-Following Models, we unlock the full potential of LLMs for robust, format-consistent interactions, paving the way for seamless integration across diverse enterprise environments.
